This guide details how to evaluate RAG pipelines using RAGAS, implement a BM25-dense hybrid search, and integrate a cross-encoder reranker, with concrete configs and operational runbooks.

Scope and terminology

This guide assumes a production RAG pipeline built on a vector store (FAISS or Milvus), a lexical index (Elasticsearch), and a cross-encoder reranker (BGE-Reranker). All components run on Linux hosts with kernel 5.15+, containerized via Docker, and orchestrated by Kubernetes 1.28. The focus is on measurable retrieval quality, latency budgets, and reproducible configuration.

RAGAS metric suite

RAGAS (Retrieval-Augmented Generation Assessment Suite) provides three orthogonal scores:

  • Faithfulness – similarity between LLM output and source documents, measured by BLEU-4 on the reference set.
  • Context Precision – fraction of retrieved passages that contain at least one ground-truth answer span.
  • Answer Relevance – average nDCG@10 using human-rated relevance labels.

Implement the suite with the ragas Python package (v0.0.22). Example snippet:

import ragas from ragas.metrics import faithfulness, context_precision # `retrievals` is a list of dicts with `question`, `answer`, `contexts` results = ragas.evaluate( retrievals, metrics=[faithfulness, context_precision], llm="gpt-4o-mini", ) print(results.mean())

For continuous integration, store the JSON payload in an artifact and compare against baseline thresholds (faithfulness ≥ 0.78, context_precision ≥ 0.71).

Hybrid BM25-Dense architecture

The hybrid search layer combines a traditional inverted index (BM25) with a dense embedding index. The workflow is:

  • Query tokenization → BM25 scoring (top-k = 200).
  • Query embedding via sentence-transformers model BAAI/bge-large-en.
  • Dense retrieval on the same top-k set using inner-product similarity (FAISS IVF-PQ, nlist = 4096, m = 16).
  • Union of BM25 and dense results, deduplicated by document ID.

Configuration for Elasticsearch (BM25) and FAISS (dense) is shown below.

# elasticsearch.yml (excerpt) index: number_of_shards: 5 number_of_replicas: 1 similarity: default: type: BM25 b: 0.75 k1: 1.2 # faiss_index_factory.py import faiss index = faiss.index_factory(768, "IVF4096,PQ16", faiss.METRIC_INNER_PRODUCT) index.train(embeddings) index.add(embeddings)

Latency impact:

  • BM25 query: 12 ms @ 1 kQPS (single node, 32 vCPU).
  • Dense query: 28 ms @ 500 qps (GPU-accelerated, RTX 4090).
  • Hybrid merge: <5 ms overhead.

The combined 95th-percentile latency is ≈ 45 ms, well within a 100 ms SLO for most chat-bot front-ends.

Cross-encoder reranking with BGE-Reranker

After hybrid retrieval, a cross-encoder refines the top-N (default = 20) passages. The BGE-Reranker model (cross-encoder, 110 M parameters) runs on TorchServe with torch.compile enabled.

# torchserve config (model-store) model_store=/models model_name=bge-reranker.mar handler=custom_handler.py batch_size=8 max_batch_delay=10

Key performance numbers (RTX 4090, FP16):

Batch size Throughput (qps) Mean latency (ms)
1 210 4.8
8 780 10.2
16 1320 12.1

Set max_batch_delay to 10 ms to keep tail latency under 20 ms while achieving > 1 kqps. The reranker adds a deterministic improvement of 0.04 to context_precision on the MS-MARCO benchmark.

Semantic chunking and overlap window

Document ingestion splits raw text into 512-token chunks with a 64-token overlap. Overlap mitigates boundary loss for multi-sentence answers. The chunker runs as a Spark job (3 executors, 8 GB RAM each) and writes JSONL files to an S3 bucket.

def chunk_text(text, max_tokens=512, overlap=64): tokens = tokenizer.encode(text) chunks = [] for i in range(0, len(tokens), max_tokens - overlap): chunk = tokens[i:i+max_tokens] chunks.append(tokenizer.decode(chunk)) return chunks

Empirical results: increasing overlap from 32 to 64 tokens raises context_precision by 0.03 at the cost of 12 % higher storage and 8 % longer indexing time.

Operational runbook

All services expose Prometheus metrics. Critical alerts:

  • bm25_query_latency_seconds{quantile="0.95"} > 0.03
  • faiss_query_latency_seconds{quantile="0.95"} > 0.04
  • reranker_latency_seconds{quantile="0.99"} > 0.025
  • ragas_faithfulness < 0.75 (daily rollup)

Remediation steps:

  • Scale dense index pods horizontally (increase replicas in the deployment).
  • Adjust FAISS nprobe from 8 to 12 to trade latency for recall.
  • If reranker latency spikes, verify GPU memory (nvidia-smi) and restart TorchServe.

Backup policy: snapshot FAISS index and Elasticsearch snapshot daily, retain 30 days. Use etcdctl snapshot save for Kubernetes control-plane state.

Architectural trade-off matrix

Dimension Option A – Pure BM25 Option B – Hybrid BM25-Dense Option C – Hybrid + Cross-Encoder
Recall@10 0.62 0.78 0.84
Mean latency (ms) 12 45 68
GPU usage 0 % 15 % 45 %
Operational complexity Low Medium High

The matrix guides capacity planning. For workloads with strict latency (< 30 ms), stay at Option B and disable reranking. For high-value QA where answer correctness outweighs cost, adopt Option C and provision dedicated GPU nodes.

Versioning and reproducibility

Pin all third-party artifacts:

# requirements.txt sentence-transformers==2.5.1 torch==2.3.0+cu121 faiss-cpu==1.8.0.post1 elasticsearch==8.12.0 ragas==0.0.22

Store the git SHA of the ingestion pipeline, the model IDs, and the FAISS index hyper-parameters in a ConfigMap. Use kubectl diff in CI to prevent drift.

Future extensions

Potential upgrades include:

  • Replacing BGE-Reranker with a 7B cross-encoder for domain-specific jargon.
  • Introducing MIPS-optimized IVF-HNSW for dense search to lower latency below 20 ms.
  • Adding a second overlap window (128 tokens) for long-form documents, measured against a 0.02 increase in storage cost.
